Verbalized Representation Learning for Interpretable Few-Shot Generalization

Abstract:
Humans recognize objects after observing only a few examples, a remarkable capability enabled by their inherent language understanding of the real-world environment. Developing verbalized and interpretable representation can significantly improve model generalization in low-data settings. In this work, we propose Verbalized Representation Learning (VRL), a novel approach for automatically extracting human-interpretable features for object recognition using few-shot data. Our method uniquely captures inter-class differences and intra-class commonalities in the form of natural language by employing a Vision-Language Model (VLM) to identify key discriminative features between different classes and shared characteristics within the same class. These verbalized features are then mapped to numeric vectors through the VLM. The resulting feature vectors can be further utilized to train and infer with downstream classifiers. Experimental results show that, at the same model scale, VRL achieves a 24% absolute improvement over prior state-of-the-art methods while using 95% less data and a smaller model. Furthermore, compared to human-labeled attributes, the features learned by VRL exhibit a 20% absolute gain when used for downstream classification tasks. Code is available at: this URL.

The Need for Few-Shot Learning

Few-shot learning is becoming increasingly vital in AI systems as they frequently encounter situations where only a limited amount of labeled data is available. Unlike traditional machine learning models that usually rely on vast datasets, few-shot learning techniques allow models to generalize from only a small number of examples. This research not only addresses the need for efficient learning under such constraints but also highlights the understanding of human cognition, particularly emphasizing our ability to recognize objects after just a brief exposure. The ability to replicate this capability in AI opens the door to numerous applications, from robotics to autonomous driving.

Introduction to Verbalized Representation Learning (VRL)

The brain utilizes language as a scaffold for categorizing and interpreting the environment, and VRL aims to harness this mechanism within AI. By capturing the nuances of inter-class differences and intra-class commonalities, the authors employ a Vision-Language Model (VLM) to translate visual features into natural language representations. This verbalization within the model offers a dual benefit: it makes the model’s decision-making process more interpretable, and it enhances its ability to learn from fewer examples, resulting in a more robust performance even in low-data scenarios.

Comparative Advantages of VRL

One of the most compelling findings presented in this research is the significant improvement VRL achieves over traditional methods. Specifically, it reports a 24% absolute increase in performance while consuming 95% less data than previous models. This is particularly promising for industries that often work with sparse datasets, as it suggests that VRL can produce high-quality outcomes with minimal resources. Additionally, VRL’s features demand fewer computational resources, thereby making it accessible for applications on a broader range of hardware.

Utilizing Verbalized Features for Downstream Classifiers

Another noteworthy aspect of the research is how the verbalized features can be seamlessly transformed into numerical vectors. These vectors are compatible with various downstream classifiers, which means that once the model is trained with VRL features, it can readily be deployed across multiple classification tasks. This interoperability widens the scope of VRL beyond object recognition and opens avenues for its application in diverse fields, such as healthcare diagnostics, retail analysis, and even creative industries.
